RMSE loss seems to be very high

The RMSE loss for the training set is $ 21877.85045061552 and the RMSE loss for the validation set is $ 29009.302517872246.
How can i reduce the RMSE loss in the training data as well as validation data?

It seems like there is only fewer salesprice after 500k. so I removed the outliers . now The RMSE loss for the validation set is $ 25633.37172676553. and The RMSE loss for the training set is $ 19432.44469138375.

Below is what i got, without removing any outliers.
RMSE loss for the training set is $ 19,630
RMSE loss for the validation set is $ 27,994

It still seems quite high, considering median value of SalePrice being 1,63,000
